Thinking about a few headcanons inspired by this lovely post by @barbieaemond
So I'm guessing since we see Criston training the boys here he was probably their primary instructor in swordsmanship and other combat skills. Aemond probably grew up hearing about his accolades, how he was almost unbeatable at tourneys knocking men to the ground in melees and wanted to learn everything there was to be like him. Criston also took this opportunity in his stride, with the young prince taking such an interest in him and decided to teach him with pride, probably also using it as a bonding exercise , which makes the Driftmark incident even more tragic, imo.
Imagine Criston seeing Aemond in pain for years later on, having to re learn everything from scratch. Maybe he finds him crying in silence, alone and angry and vows to push him, to teach him everything in his power to help him regain his confidence. Perhaps the only way he knows how to show he cares is through their mutual love for excellence, which happens to be training for battle. He grills him hard thereafter, pushing him to his limit, not letting him back down and Aemond revels in it. He finally finds someone who isn't treating him like he's made of glass, who still sees his potential, who isn't afraid or disgusted by him and he learns to open up again. I also imagine Criston monitoring his progress and gifting him his first valyrian steel sword. I don't think the white cloaks ever got paid so maybe he hatches a plan with Alicent to gift it to him as a reward a few moons later and every time he succeeds and manages to beat him he looks on in pride as Aemond grins or smirks at his little victories.

How funny that they seem to have made Aemond a mama's boy on the show, when in the book he won't even bother trying to free her when he has the biggest world dragon at his disposal. 😂
Aemond wanted to immediately attack King’s Landing when he heard about it.  Criston Cole advised him against it and said that it was better for them to merge their forces with the Hightowers’ and meet up with Daeron at Oldtown. Whenever the missing Aegon II he shows up again, they would meet with him and then come up with a plan to free Alicent and the rest. Aemond thought this was a cowardly thing to do and flatly refused.
HOWEVER, they seemed to have argued more and things might have gotten heated beween them. It was decided that Cole will go on with his plan alone and he took their soldiers towards Oldtown. 
Aemond, who before was adamant about going to King’s Landing, chose to stay behind and draw Rhaenyra out by flaming the riverlands, as you say.
So something happened for him to change his mind. I think we can definitely say he was intimidated by his lack of backup and decided to prove his authority, bravery, and “good” judgement by acting alone and “fight his own war, raining fire on the traitors from the air” (Fire and Blood; The Red Dragon and the Gold).
*EDIT* That, but more importantly he wanted to prove himself as more capable than Daeron or Aegon and get some glory for himself when Cole brought up that waiting for Aegon and joining Daeron was their smart play. Yes, Aemond figured proving he was Mr. tough Guy was more important than saving his mother and sister or winning this war for the greens--at the cost of military strategy. *END OF EDIT*
Alicent became less important than him proving a point.
Plus, we never hear anything about her or Helaena specifically from Aemond. It was more about Rhaenyra and Daemon dared to get one on him.
Prince Aemond had kept Vhagar with the main column throughout the march, thinking that his uncle might attempt to attack them on Caraxes. He reached Harrenhal a day after Cole, and that night celebrated a great victory; Daemon and “his river scum” had fled rather than face his wroth, Aemond proclaimed. Small wonder then that when word of the fall of King’s Landing reached him, the prince felt thrice the fool. His fury was fearsome to behold.

This mirrors how Daemon had his the messenger whipped after he learns of Rhaenyra becoming heir. 
Except, you know...Aemond later kills an entire family's male members (adults and kids) and makes a house go extinct in his rage, and based on a suspicion that Larys Strong--a longtime green supporter and there from the beginning in his support--helped Rhaenyra to get King’s Landing. Didn't matter that the Strongs had already surrendered.
Because Larys is Harwin’s brother, and Harwin was the alleged father of the nephews Aemond hates.
*EDIT* And later when he rejects Criston's plans on how to actually attack and reclaim Kings' Landing, he makes his own plan to draw a couple of Rhaenyra's dragonriders out so he can destroy them, and she does send out Daemon and Nettles. Still, the quote above and Aemond's insistence on not taking "craven" courses, frames as it was very closely to when he uses Rhaenyra's gender and motherhood as her weakness and his advantage, we see he is very motivated by not looking not just weak, but "womanly" or having a "woman's weakness". *END OF EDIT*

Did Aemond really leave his men to run off with Alys Rivers?
Read the two quotes I give in this post HERE.
Aemond didn't run away from his men nor Criston's men. Criston leaves him, and leaves with the remainder of the soldiers they had before going to Harrenhal.
Aemond does leave behind Alys at Harrenhal 3 days before Sabitha Frey takes it. After that, he goes around burning the riverlands' various villages and castles, trying to draw Rhaenyra out or any of her dragonriders out to confront him. He comes back sometime after Criston Cole dies with the rest of the army way down south, burning the wooden structures of Harrenhal, forcing Sabitha to return to the Frey Twins, and taking Alys back with him.
But Aemond doesn't travel with Criston and the army for a "mysterious" reason. I took it that part of it was that Aemond didn't want to bring Alys with them nor portray himself as "weak".
EDIT: I also think Aemond wanted to defy Criston's protests against Alys and either allowed him to go after their argument or ordered him to. (LINK)
